Bah, turned out I was connecting to IMAP instead of IMAPS and that is why it was working. After making sure I was using IMAPS I was not longer able to connect, again with the "No supported cipher suite ..." error. I did however manage to fix it my doing "apt purge courier-imap" and then "apt install courier-imap" and after acccepting the new certificate all was well!
